I taught some of these beliefs to paying clients.

With a straight face.

I want to save you the years I spent finding out I was wrong.

Here are the 7 you should kill first:

1/ AI is just autocomplete

You will hear this from the smartest engineer on your team and it will sound wise.

It is not.

A calculator is just arithmetic, and it still put humans on the moon.

Arguing about the mechanism stops you asking the only question that pays, which is what this model can do once you wire it into a system with real tools.

I watched this with Hector Beverages [Here is the Case Study].

A smarter model did not fix their sales pipeline.

We built the workflow around n8n on AWS and let the model do the narrow thinking it was good at.

The model was the least interesting part of that build.

The plumbing carried the value.

2/ AI will replace engineers

It will not replace you.

It is quietly eating the ladder underneath you, which is a much stranger problem.

Think about what made you good.

You did boring tickets, fixed small bugs, and read other people’s code because someone handed you a task too small to matter.

That is how you built taste.

A model does that work in 20 seconds now, and the junior engineer who would have grown from it never gets the reps.

If you lead a team, you now own a training problem you did not sign up for.

If you are the junior, you have to manufacture those reps on purpose, because nobody hands them to you anymore.

3/ Prompt engineering is the skill

People have built their early positioning on this.

They were wrong within about a year.

Models got good at following instructions.

What they never got good at is knowing what they are allowed to see.

When I audit a client’s broken agent, the prompt is almost never the problem.

The problem is that the agent has no idea who is asking, what that person can access, which document actually matters, or what happened 3 steps ago in the conversation.

No need to rewrite your prompt.

Start deciding what the model sees, in what order, with what permissions.

That is the job now.

Everything else is decoration.

4/ RAG fixes hallucinations

I told a client this once.

I believed it.

Then their system confidently gave a wrong answer to a real user and I had to go explain why.

Here is what RAG actually does.

It changes what the model reads before it answers.

That is all.

Your chunker splits a table in half, your retriever grabs the confident-sounding wrong document, your source file went stale 18 months ago and nobody noticed.

And even when everything upstream works perfectly, the model still misreads the paragraph sitting right in front of it.

RAG gives your model access to information.

It does not make your model honest.

Those are completely different problems, and you need to solve the second one separately with evaluation.

5/ More agents means more intelligence

Give me an invoice.

I need the vendor, the amount, the date, the tax, the invoice number.

That is one prompt with structured output and about 20 minutes of work.

I have sat in reviews where a team built a Manager Agent coordinating a Vision Agent, a Finance Agent, a Tax Agent, and a Validation Agent for exactly that.

They were proud of it.

It was also slower, more expensive, impossible to debug, and it failed in ways nobody could reproduce.

My order, and I hold to it:

• prompt with structured output

• then a workflow

• then tools

• then one agent

Multi-agent only when you can point at the specific thing one agent genuinely cannot do.

Most teams never need to pass step 2 and add 3 more anyway, because agents feel like progress.

Complexity is not intelligence.

It just looks like it in a diagram.

6/ Benchmark tells you it works

You will read that a model scored beautifully on some coding benchmark and you will feel reassured.

Do not.

OpenAI stopped using SWE-bench Verified for frontier evaluation after finding that a large share of the failed problems had broken tests that rejected correct answers.

The model was not failing.

The test was.

And that is the benchmark half the industry quoted for 2 years.

Now think about your own work.

If a public benchmark built by serious people can be that wrong, what do you actually know about how your system performs on your data, in your workflow, when a real user types something weird into it?

Usually nothing, because you never built the evaluation.

You watched the demo work and moved on.

Build the eval.

It is boring, and it is the single thing that separates people who ship AI from people who demo it.

7/ We use AI, so we are transformed

This is the most expensive belief on the list, and it lives at the leadership level.

Your team uses ChatGPT.

Somebody connected the CRM to a model.

Somebody put “AI first” in a deck.

None of that changed how the company makes money.

One person saving 2 hours a week does not move your P&L.

It moves their afternoon.

The economics shift only when you redesign the workflow around what the model can now do, which means touching roles, approvals, handoffs, and who decides what.

That is organizational work, not technical work, and it explains why most AI budgets disappear without anyone being able to say where.

Let me start with a mistake I made for almost a year.

I used to think I was doing “advanced prompting.”

I would write a long prompt, tell the AI to keep trying until the tests pass, and walk away.

Most of the time it worked.

Sometimes it did not, and I had no idea why.

The agent would just keep looping on the same wrong fix, burning tokens, until I noticed and killed it manually.

That is a coin toss with an electricity bill, lol.

You have probably done some version of this too.

Everyone who has spent real time with a coding agent has that one story where it spun for twenty minutes on nothing, and you only found out when you checked your token spend.

This guide is what I wish I had understood before that happened to me.

What loop engineering actually is, why it became a real discipline this year and not 2 years ago, how you build your first one this weekend, and what breaks if you skip the boring parts.

1/ What loop engineering actually is

Loop engineering is the practice of designing how an AI agent repeats work on its own, on purpose.

Not keep trying until it works, which is what I was doing for that whole year.

You decide exactly what trying means, what working means, and what happens when it does not work after a fair number of attempts.

3 things every real loop needs, I learned all 3 the hard way:

• a way to act, the agent does something, writes code, calls a tool, edits a file

• a way to check, something other than the agent itself decides if the result is actually correct

• a way to stop, a clear rule for when to end, either because it succeeded, or because it failed enough times that you should look at it

Miss any 1 of these and you do not have a loop.

You have an agent talking to itself in a room with no exit, which is exactly what mine was doing.

Here is the naive version, the one I was running without realizing it:

Look at agent.thinks_it_is_done

The same agent that did the work is also grading its own homework.

It will often say yes when the answer is wrong, especially once it has burned a few attempts and wants to be finished.

Here is the version that actually works, with a separate checker:

The difference looks small in code.

It is not small in behavior.

checker is a different process, a test suite, a linter, a second model with stricter instructions and none of the maker’s context.

It has no reason to be generous.

And if nothing passes after max_tries, the loop does not spin forever, it hands the problem back to you.

That one function, escalate_to_human, is what separates a loop I designed from a script that happened to get lucky.

2/ From human-in-the-loop to human-on-the-loop

There is an older idea in AI called human-in-the-loop.

It means you sit inside every step.

You type the prompt, you read the answer, you type the next prompt.

This is how most people still use AI, and it works fine for small tasks.

It is also how I used AI for 2 straight years without questioning it.

Loop engineering moves you to a different position, human-on-the-loop.

You are not inside every step anymore.

You design the system once, the rules for acting, checking, and stopping, and then the system runs the steps by itself.

You watch from above and step in only when it asks for you, or when something looks wrong.

Check the architecture to understand it better:

I think about it like the difference between driving a car and setting cruise control with lane assist.

In the first case, you touch the wheel every second.

In the second, you built the system that touches the wheel, and you supervise it.

You have not stopped driving.

You have changed what part of driving you are responsible for.

3/ Shape of a Loop

Every real agent loop, no matter how fancy the tool wrapping it, runs on the same 3-step cycle.

Researchers call it ReAct, short for Reason and Act.

• Reason, the agent looks at where things stand and decides the next move

• Act, it actually does that move, runs a command, edits a file, calls an API

• Observe, it looks at what really happened, not what it hoped would happen

• Then it checks whether it’s done

• If not, back to Reason

• If yes, stop

Reason leads to Act, Act leads to Observe, Observe leads to a decision, and if the decision is “not yet,” you are back at Reason with new information.

That’s the whole cycle.

Everything I will describe below, schedulers, checkers, state files, is scaffolding built around this one small loop so you can trust it running unattended.

4/ Why now, the 2026 convergence

One cohort member of AI Engineer HQ Accelerator asked me why loop engineering is suddenly a topic this year and not in 2023, when AutoGPT tried almost the same idea and mostly failed in public.

The idea itself is not new, but what changed is that 3 separate things matured at the same time, and together they made the idea actually work:

Lets understand each of them one by one:

1 - MCP gave agents a shared way to use tools

Back in 2023, if you wanted your agent to read a file, call an API, or check a database, you wrote custom glue code every single time.

The Model Context Protocol (MCP) fixed that.

It gives agents one standard way to discover and call tools, no matter who built the tool or who built the agent.

For a loop to work, the Act step needs tools it can call reliably, the same way, every time.

Before MCP, that reliability did not really exist at scale.

2 - Coding agents got native loop primitives

In 2023, using AI to code meant copy and paste.

You asked for a function, pasted it into your editor, ran it yourself, pasted the error back if it failed.

By 2026, tools like Claude Code run inside your terminal, read your whole repository, write files directly, run your own tests, and read the output without you touching anything.

The reason, act, observe cycle I described above is now something these tools do by default, in seconds, over and over.

You are not inventing the loop from scratch anymore.

You are shaping one that already exists.

3 - Latency dropped enough to make loops practical

A loop that takes 30 seconds per cycle is annoying but usable.

One that takes 3 minutes per cycle is something you abandon halfway through.

Faster models mean an agent can run through many reason-act-observe cycles in the time it used to take to get one slow response.

A stop condition like retry up to 5 times only makes sense if 5 retries don’t cost you your whole afternoon.

You needed all 3 at once, not just one.

Fast models with no shared tool standard just means your agent hallucinates faster.

A tool standard with slow models means your loop technically works but nobody has the patience to run it.

2023 had pieces of this but in 2026 has all 3 landing together, and that’s the actual reason this became a named discipline instead of a research curiosity that quietly died.

I saw the floor for entry drop firsthand.

In my own cohort, teaching someone to build an agent loop 2 years ago meant a full week of wiring raw API calls together by hand, and most people gave up around day 3.

Now the same person opens Claude Code, writes one file describing the rules, and has a working, self-correcting loop by the end of session one.

5/ From prompting to goal-seeking

Here’s what changes how you actually work, not just what tool you open.

The best teams stopped prompting for big tasks.

They design systems that chase a goal on their own, and only step in when the system gets stuck.

Prompting looks like this:

• you want a feature built

• you type a detailed request

• read the output

• notice it missed something

• correct it

• read again

• notice a bug

• correct again

• You are the loop and very cycle needs your typing

Recursive goal-seeking system looks different:

• You give it one goal

• add authentication with tests passing and no security warnings

• the system breaks that into smaller goals, it works each one

• when a smaller goal is still too big, it breaks that down again

• until every piece is small enough to finish in one clean pass

solve calls itself

If the goal is small, add one specific test, the agent just does it.

If it’s still too big, build the whole auth system, the agent splits it and calls solve again on each piece.

That keeps happening until every piece is small enough, and the results combine back into the full feature.

This is the actual mechanism behind words like agentic workflow that get thrown around loosely.

Underneath the marketing language, it’s recursion applied to a real goal instead of a number.

I stopped treating big builds as one giant prompt a long time ago.

When I want a full project shipped, I give the top goal once and let the system break it into a triage step, a build step, and a QA step, each one working a smaller slice and reporting back up.

A recursive goal-seeking system isn’t more capable because the model got smarter.

It’s more capable because the structure around the model does more of the thinking about how to break the problem down.

6/ [Hands-on] Build Your First Loop

You don’t need to install anything new for this if you already use Claude Code.

/goal is exactly the maker-and-checker pattern from engineered_loop, built in.

Pick something small and boring in a real project.

Something clearly checkable, the way checker.verify needs to be.

1. Open Claude Code in your project.

2. Write down what done looks like before you touch the agent. Not a vibe, a test. Something like: every file in src/utils passes ESLint with zero warnings, and npm test still exits 0.

3. Run it: /goal every file in src/utils passes eslint with zero warnings, and the full test suite still exits 0

4. Turn on auto mode so it doesn’t stop to ask permission on every edit, and let it run.

5. Watch the first few turns. You’ll see the agent make an edit, then a separate evaluator pass judge whether the condition is met. That second step, happening as a genuinely different pass, is the whole discipline compressed into one command.

6. When it finishes, run /goal with no argument. It shows turns elapsed, tokens spent, and the evaluator’s last reason. Look at the token count. It matters more than you’ll expect the first time.

Do this same exercise 3 or 4 times on different small tasks before you touch parallel agents or a schedule.

Writing the condition is the actual issue.

No amount of orchestration fixes a vague goal, the same way no amount of max_tries fixes agent.thinks_it_is_done

You type 6 words into a chatbot.

Behind that one sentence:

• 8 named systems

• 2 guardrail models

• 1 hybrid search

• a GPU doing 2 completely different jobs in the same second

Here is the exact stack, zone by zone:

Most how LLMs work posts stop at the model.

The model is 1 station on a line with 8 stations.

I am going to walk through a single request end-to-end and name every component doing the work.

If you are building this stack yourself, or drawing it out for your team.

Think of a query you asked any AI chatbot: What is the status of shipment #9120?

[Zone 1] API Gateway + Redis Semantic Cache (0 to 5ms)

The request hits a gateway first, usually something like LiteLLM sitting in front of your model endpoints.

Before anything touches a GPU, the gateway checks a semantic cache, typically Redis holding vector embeddings of recent queries.

Here is the mechanic worth knowing: it is not checking for an exact text match.

It embeds the incoming query and checks cosine similarity against cached query vectors.

If something above a threshold, say 0.95, is sitting there with a valid TTL, you get the cached response back in milliseconds, and the request never reaches the model at all.

Semantic caching is safe for static knowledge and dangerous for live state.

If the query has never been asked, it will be a cache miss and the query will be sent to the next zone (in our case, zone 2).

Why this zone exists:

• a GPU forward pass is the most expensive step in the pipeline

• any request you can answer from cache is a request you never pay compute for

[Zone 2] Input Guardrails - Presidio + Llama Guard (5 to 15ms)

2 things run in parallel here, and they solve different problems.

Presidio (by microsoft) scans the text and masks PII, phone numbers, account IDs, anything that should not sit unmasked in logs or get echoed back later.

Llama Guard, usually a small fast 1B parameter model running locally rather than the big model you are paying per token for, classifies the input for jailbreaks and prompt injection.

This is the layer that catches ignore previous instructions and dumps the system prompt before your expensive model ever reads it.

This is a specific architecture pattern worth naming - dual-LLM guardrailing.

A cheap model polices a query before and after the expensive model touches it.

You are not relying on the big model’s own alignment to save you.

You are putting a second, dumber, faster model in front of it as a bouncer.

Query passes, clean and move to Zone 3.

[Zone 3] Orchestration - LangGraph State Machine (15 to 25ms)

This is the part most explainers skip entirely, and it is the actual brain of the system, not the LLM.

A state machine, commonly built in LangGraph, parses the query and decides what needs to happen next.

It is not generating an answer, but it is routing.

Remember, if you can add routing to your architecture, it will reduce the overall cost of your AI system significantly.

In this case, it determines the query needs shipping data the model was never trained on, so it flags a retrieval step.

Think of this zone as the dispatcher.

Every request passes through it, and it decides which of the downstream zones actually get invoked.

Not every query needs Zone 4.

A greeting (like Hi, How are you doing today?) does not need a database lookup.

[Zone 4] RAG 2.0 Retrieval Engine (25 to 200ms)

This is the zone with the most moving parts, and the one worth understanding in full, because it is also the zone where production systems fail most often.

If the vector search cannot find #9120:

3 sub-steps, each solving a different failure mode:

1/ Hybrid search

The query runs through 2 retrieval methods at once against a vector database like

1. Qdrant - dense vector search for semantic meaning

2. BM25 - keyword search for exact matches like a shipment number

Vector search alone will miss 9120 because embeddings capture meaning, not exact strings.

The 2 result sets get merged with Reciprocal Rank Fusion, a formula that combines rankings from both lists into one, weighted so a document ranked well by either method rises to the top.

2/ Cross-encoder reranking

The hybrid search returns maybe 50 to 100 candidates.

A reranker (Cohere’s rerank model is the common production choice) reads the query and each candidate together in a single forward pass and re-scores them for actual relevance.

This is slower than the first search but far more precise, which is why it only runs on the shortlist instead of the full database.

This 2-stage pattern, cheap broad search followed by expensive narrow reranking, shows up everywhere in production retrieval.

3/ Prompt compression

The top 3 to 10 chunks get compressed, often with a tool like LLMLingua, stripping redundant tokens and boilerplate so the model receives a dense payload instead of a bloated one.

This matters because every token here is a token you pay for and a token that adds latency downstream.

This is also the zone behind the more expensive production failures you will encounter.

The fix is hybrid search + a schema check on the output, which is exactly Zones 4 and 7.

[Zone 5] GPU Compute - vLLM Serving Stack (200 to 1200ms)

It is one zone out of 7, and it splits into 2 phases that behave nothing alike:

1/ Prefill

The model, served through something like vLLM or TensorRT-LLM, ingests the full prompt at once and computes attention across every token in parallel.

This phase is compute-bound, meaning it is limited by how many floating point operations the Tensor Cores can push per second.

The time this phase takes to produce the first output token has a name you will see in every serving benchmark: TTFT (time to first token).

In this trace, 450ms.

2/ Decoding

The model now generates tokens one at a time, autoregressively (each one depending on every token before it).

Here is the part that will surprise you:

This phase is not compute-bound at all, but it is memory-bandwidth-bound.

For every single token, the GPU has to move the entire set of model weights, potentially tens of gigabytes, from HBM (the GPU’s main VRAM) into SRAM (the small fast cache next to the compute cores) and back.

The issue is how fast you can move data across the memory bus.

This is why PagedAttention matters and why you will see it named specifically in any serious inference stack.

To avoid recomputing attention for every previous token at every step, the model stores keys and values for tokens it already processed, and that is the KV cache.

It grows with sequence length and batch size, and at long context it can outweigh the model itself in memory.

Before PagedAttention, servers reserved 1 big contiguous block per request, sized for the longest possible answer, used or not.

That wasted 60 to 80 percent of KV cache memory.

PagedAttention borrows paging from operating systems, breaking the cache into small blocks allocated on demand.

Waste fell under 4 percent, and one server could hold several times more conversations on the same hardware.

That single change cut memory waste to under 4% and let a single server handle several times more concurrent users on the same hardware.

By 1200ms, all 150 output tokens are generated, at roughly 8ms per token during decode.

Note: Real chat UI streams tokens as they generate and if you wait for the full 150 tokens before validating, you have destroyed perceived latency.

[Zone 6] Output Guardrails - Instructor + Llama Guard (1200 to 1230ms)

Before the response leaves the system, two checks run.

Instructor, or a Pydantic schema validator, confirms the model’s output actually matches the expected structure, valid JSON, correct fields, and no malformed output that would break the calling application.

Llama Guard runs again, this time on the output, checking that no system prompt leaked and no sensitive data slipped through in the generated text.

[Zone 7] Delivery (1230 to 1250ms)

The validated response reaches the client.

Total time from keystroke to answer: 1.25 seconds.

That number is the sum of every zone above it, and it is the number your users actually experience, even though they only ever see Zone 5.

Let’s put everything together:

Layer wrapping all

Most important remaining here is tracing, from OpenLLMetry or Langfuse + an eval set you own.

Without a trace across all 7 zones, you cannot answer which zone made this wrong

Without an eval set you find out retrieval degraded when a customer tells you.

I build them before I need them now, which took me longer to learn than it should have.

Here’s what actually worked for me.

I didn’t get rid of the doubt.

I learned to build next to it instead of waiting for it to leave.

Stop Trying To Know Everything

When I started MasterDexter, I thought I had to know every model and every paper before I could stand in front of a cohort and teach.

That pressure will wear you down before it teaches you anything useful.

AI moves too fast for one person to hold all of it.

So I stopped trying.

I went deep on what my work actually needed.

I stayed aware of the rest, not fluent in it.

And I built a team around the gaps, like my CTO Karan at Dextar, who knows the infrastructure side better than I ever will.

Turn the Doubt Into a Log

The doubt hit hardest during specific moments.

The week my Substack account got suspended in the middle of a cohort launch.

Talk To People Outside Your Own Head

Some of the most useful conversations I have had this year were with cohort students admitting they felt behind, other founders in DMs saying the same thing I was thinking.

Nobody had it as figured out as their LinkedIn made it look.

That was a relief I did not expect.

I was not behind.

I was not supposed to have every answer before I taught the next class or took the next consulting call.

Confidence Is a Rep, Not a Finish Line

I used to think confidence would show up once I’d learned enough.

That’s backwards.

Confidence comes from doing the thing, writing down what happened, and doing it again.

That’s true whether I’m debugging an agent or walking into a room with a client’s leadership team who’s never heard of me.

I still feel the doubt some mornings.

I move anyway.

Every small ship compounds.

Momentum beats perfect, every time.

Saying AI Certifications are a waste of Time is wrong

The issue is not whether the certification will help you get a job, it’s whether it has market credibility.

Most jobs don’t need certifications.

I asked the same questions of my friends who are hiring managers.

Here is what they said.

Many people with professional-level certification can’t do the job when it comes time to deliver.

Because of that, we have to evaluate skills for the role fully.

Hiring managers are asking show me the agent you built, what broke, and how you fixed it.

Clearing a certification exam often tests theoretical knowledge or memorization skills, not practical expertise.

So we don’t only focus on whether the candidate has the certification or not.

Certifications Are More Important In Specialized Fields

Suppose you want to work in MLOps or LLMOps

In that case, the certification will have value as it tells the company that you know about a specific cloud platform like GCP, AWS, or Azure.

Somewhere around 12 to 25% on base pay depending on the role.

That’s the one category where the badge is still doing economic work.

Cloud certification is often shown to clients by service-based companies to demonstrate their expertise on cloud platforms.

It will drive business for them.

AI Leadership

It’s a leadership position.

No one can teach you how to lead a successful AI product.

85% of AI development fails because of a variety of reasons.

You work in chaos, and certifications will not help in solving the real-world AI mess.

But,

If you still want to go for a certification, I will recommend you do these 2 things:

1. choose an established individual creator who has credibility in the AI community

2. whatever you learn, make sure you apply the knowledge right away (I do that in The Elite)

Here’s What To Do Instead:

Follow my PILOT framework:

Problem > Insight > Learning > Outcome > Traction

1. Start with a real problem

2. Find your insight

3. Learn only what the build needs, right when you need it

4. Then outcome which means deploy (shipped beats polished)

5. Last part is traction, document what broke, share with the world

That’s the credential you shipped, broke, and fixed while someone was watching.

The proof that you are a problem-matter expert.

I believe

If you have the certification and don’t answer the questions in the interview, then that certification doesn’t matter.

If you do not have the certification but answer the questions in the interview, then again certification doesn’t matter.

A certification will get you to the interview round max but never guarantees getting the job.

Certifications have their place, but they cannot be in the place of experience.

The only skill you need for a great career is the willingness to learn.

If learning is your priority, you don’t mind paying money for quality liquid knowledge.

AI strategy for people who make real decisions.

Every morning, a small team at HectorBeverages that makes Paper Boat opened Outlook and did the same 5 minutes, 50 times.

• open the email

• find the PDF

• convert it to Excel

• file it in SharePoint or forward it along

A purchase order here, a delivery confirmation there, a sales summary buried in an attachment nobody wanted to open.

Paper Boat is a brand built on nostalgia.

Traditional Indian drinks, sold on memory and feeling.

And underneath that brand, the sales operations were running like it was still 2009.

Manual and repetitive.

Held together by people who were good enough at their jobs to never let it visibly fail.

That is the trap.

When manual work never visibly fails, nobody calculates what it costs.

If you are a Head of AI or an AI Architect evaluating automation for a non-technical business team, this is written for you.

Not a polished pitch.

A raw account of what we built, what broke, and what a team of 5 to 10 non-technical people learned about automation by the end of it.

Cost Nobody Had Calculated

50 emails a day.

5 minutes each.

250 working days a year.

Run that and you get 1,042 hours annually spent opening PDFs.

At $10 an hour for the operations staff doing it, that is $10,420 a year, gone into a task nobody thought to question.

Nobody had run that number until we did.

Formula, if you want to run it on your own team

You do not need a vague productivity gain claim to take to a CFO.

You need a number you can defend. Here is the one we use.

Annual Time Saved (hours) = (Daily tasks automated x Minutes per task x Working days per year) / 60

Annual Cost Saved ($)     = Annual time saved (hours) x Average hourly cost of the person doing it

Total Automation Cost ($) = One-time build cost + (Monthly infra cost x 12) + Annual maintenance hours x dev rate

ROI (%)                   = (Annual Cost Saved - Total Automation Cost) / Total Automation Cost x 100

Payback Period (months)   = Total Automation Cost / (Annual Cost Saved / 12)

Applied to this project:

3 costs most leaders leave out of this math entirely, and all 3 are real:

• Error correction

  • manual PDF entry runs 1 to 5 percent error rates

  • one wrong quantity or price cascades into chargebacks and disputes you do not see coming

• Cognitive load

  • repetitive data work burns people out

  • error rates climb toward the end of a shift

  • that cost never shows up on a spreadsheet

• Opportunity cost

  • a person spending four hours a day on PDF extraction is not doing account management or analysis

  • automation does not just save time

  • it frees capacity for the work that actually needs a human

Why We Didn’t Reach for LangChain

The moment automate this comes up in a room, someone says LangChain or CrewAI.

Or some agentic framework with a name that sounds like it belongs in a research paper.

Here is the uncomfortable part.

For this problem, all of that would have been wrong.

The HectorBeverages team was 5 to 10 people in sales operations.

• not developers

• not data engineers

• some had touched Power Automate through their existing Microsoft stack

None of them could read a Python stack trace, and none of them should have to.

LangChain is a real framework.

It assumes you can read code, understand how an agent reasons, and debug a broken environment on a Friday evening.

CrewAI is the same story with different jargon.

Both earn their complexity when the intelligence is the hard part, when a system has to reason through unpredictable input and adapt.

This was not that problem.

Get email > find PDF > convert it > store it > notify

Same steps, same order, every time.

That is a pipeline not an agent.

We built it in n8n instead.

A visual canvas where every step is a node you can see and click into.

When something breaks, the operations manager in Gurgaon does not need a developer.

She needs to look at the screen.

Decision framework (so you don’t get this wrong on your own project)

Most leaders pick a tool based on what is trending, not on who will be operating the system 6 months after go-live.

Use this before you choose anything.

HectorBeverages sat in the bottom left.

Low complexity, non-technical operators.

3 questions to ask before you choose a tool:

1. Who breaks it?
   
   If the answer is the sales ops manager in Gurgaon, your tool has to be self-diagnosable
   - no stack traces
   - no terminal access
   

2. Is the logic adaptive or deterministic?
   
   Deterministic means the same input always gives the same output.
   
   You do not need an LLM for that
   You need a reliable pipeline
   
   - adaptive means the system has to reason and change approach based on context
   - that is when the complexity earns its cost
   

3. What does maintenance cost in human hours, not just dollars?
   
   A well-configured n8n workflow on a small EC2 instance runs around $50 a month or less
   
   A framework that needs a developer for every change can cost ten times that in engineering hours alone

If you want a rule of thumb:

if the person who owns this in 12 months cannot describe what it does without opening a code editor, you have chosen the wrong abstraction level.

Approval checklist for Leaders

Before you sign off on any automation project, answer these:

• can the person who will own this in 12 months describe it without code?

• is the payback period under 6 months?

• do we have a static IP or stable endpoint for webhooks?

• are credentials documented with rotation dates?

• is there a human checkpoint for high-risk steps?

• do we have a monthly health check process?

• are error alerts going somewhere a human will actually see them?

• does the team have at least one person who can own this internally?

All 8 checked, approve it.

4 to 7, fix the gaps before go-live.

Under 4, the project is not ready.

Build and Train Your Team at the Same Time

What made this project different from a normal handover was that we built and trained at the same time.

The team watched the system get built, then built their own version alongside it using the same nodes.

By the end, two systems existed.

Ours running production.

Theirs as the thing they actually learned from, mistakes included.

That is the real difference between delivering a system and delivering a skill.

A team that owns a working pipeline still calls you when it breaks.

6 weeks in, the 50-emails-a-day problem was at zero.

Every incoming PDF gets processed, converted, filed, and summarized without a human touching it.

The team’s time moved from data entry to exception review, which is a better job by every measure that matters.

The disproportionate use of em-dashes (—), contrastive sentence structures such as “It is not X, but rather Y,” and highly formulaic formatting (bullet points, bold text, emojis, and repetitive transition words) are among the most recognizable traits of modern AI-generated text.

To help you understand why this happens and how to fix it, this guide breaks down the underlying technical mechanics that drive these patterns:

• training

• reinforcement learning

• token probability

Part 1/ Why AI Text Generates AI Slop

To understand why LLMs write this way, you must look at how they are trained and aligned.

Models do not write like natural humans because they are optimized to satisfy a specific mathematical reward system.

1/ Em-Dash Paradox

If LLMs are trained on human-written web text, and humans rarely use em-dashes in everyday writing, why does AI text use them constantly?

Here are some common causes for it:

[Cause A] High-Quality Data Bias

During pre-training, data curators filter the internet to remove low-quality text (such as casual social media posts, chat logs, and unedited comments).

They prioritize high-quality, edited, and formal text, including:

• published books

• academic papers and scientific journals

• professional journalism (like New York Times, The Economist)

• structured documentation and Wikipedia

In these formal, heavily edited mediums, the em-dash is a common punctuation mark used to insert explanatory clauses without breaking a sentence’s flow.

Because the model’s pre-training data is heavily skewed toward this subset of formal writing, its baseline token probability distribution favors the em-dash over simpler conversational punctuation.

[Cause B] RLHF Punctuation Clumping

During Reinforcement Learning from Human Feedback (RLHF), human annotators grade different model outputs.

Annotators consistently reward outputs that look:

• comprehensive

• authoritative

• expertly written

To appear sophisticated, models use nested sentence structures.

The em-dash is a highly efficient token pattern for this task:

Simple: ”The database crashed because the disk was full. This halted our servers.”

AI Style: ”The database crashed—a direct consequence of storage exhaustion—halting our servers.”

Because the nested sentence appears more cohesive and academic, RLHF annotators rate it higher.

Over millions of training steps, the model’s weights adjust to favor the em-dash token sequence, leading to its over-representation in production.

2/ Rhetorical Shortcut: “It’s not X, it’s Y”

The constant use of contrastive framing (e.g., “AI is not a replacement for human work; rather, it is a collaborator”) is a linguistic pattern driven by the model’s optimization for consensus.

[Cause A] Safety Alignment and Nuance Constraints

Model providers train LLMs to avoid making overly simple, biased, or extreme claims.

If a user asks a model to define a complex topic, a simple, one-sided answer might violate safety or neutrality guidelines.

The contrastive structure “It is not merely [Simplistic View], but rather [Nuanced Synthesis]” is a highly effective way for the model to generate a safe, neutral response.

It allows the model to address and reject a potential misconception while presenting a balanced, compliant answer in a single sentence.

[Cause B] Persuasive Mimicry

Because LLMs cannot experience true conviction, they rely on classic rhetorical templates to sound persuasive.

Contrastive structures are common in persuasive writing and public speaking because they establish clear emphasis.

The model uses this template as a shortcut to make its statements sound profound, even when the underlying concept is simple.

Part 2/ How to Generate Human-Like Text

To remove these artificial patterns and generate text that reads like natural human writing, you must adjust both your system prompts and your API configurations.

1) Prompting Strategies:

To eliminate artificial patterns, you must provide the model with explicit instructions detailing what styling elements to avoid.

Add this instruction block to your system prompts or custom instructions to strip out the model’s default stylistic habits:

2) Few-Shot Mimicry Pattern

The most effective way to teach a model how to write like a human is to provide concrete examples of actual human writing within the prompt.

This is called Few-Shot Prompting.

3/ API Parameter Tuning

If you are calling LLMs programmatically via API (e.g., using OpenAI, Anthropic,

or vLLM), you can adjust the model’s generation parameters directly to disrupt

these repetitive patterns.

• temperature=0.9 & top_p=0.9 standard models default to a conservative temperature (e.g., 0.7 or lower), which forces them to choose the safest, most predictable words (like “delve” or “tapestry”).

• Raising the temperature to 0.9 forces the model to select slightly less common, more natural word combinations.

• frequency_penalty=0.5 this setting applies a mathematical penalty to tokens that have already appeared in the text.

• This prevents the model from repeating its favorite transition words, punctuation marks, or sentence templates during generation.

The AI Field Report | Every Quarter

What the people building AI actually disagree on, and why that’s your opening.

The smartest person in AI right now might be the one who told you he has never felt more behind.

Andrej Karpathy said that earlier this year.

The guy who coined vibe coding.

If he feels behind, sit with that for a second before you decide you understand where this industry is going.

I pulled these ideas from research papers, podcast transcripts, funding filings, and a few uncomfortable admissions from people who run the labs.

Some of these will contradict each other.

Good.

The industry itself has not agreed on anything yet, and anyone selling you certainty is selling you something.

1/ Slowness Is Not Typing Speed Anymore

For 30 years, a programmer’s ceiling was how fast they could think and type at the same time.

That ceiling is gone.

Through late 2025 and into 2026, Karpathy was spending 16 hours a day directing coding agents instead of writing code by hand.

In his own words, he had to “express his will” to his agents, not his fingers.

• What replaced typing speed is judgment.

• Task decomposition.

• Knowing which output to trust and which to throw away

• Verification

The stuff that used to be a small slice of a developer’s day became the whole job.

Here’s the twist that makes this idea sharper, not weaker: in May 2026, Karpathy joined Anthropic to run a research team inside its pretraining group.

The person who built his reputation on staying independent, directing swarms of agents solo, walked back inside a frontier lab within months.

He’d already said the honest part out loud before he did it: staying outside means your judgment drifts, because the models are opaque and you need to be inside to really understand how they work.

Even the person most convinced that management-of-agents was the whole future decided he needed the lab’s raw materials to keep that judgment sharp.

2/ Ideas Got Expensive Again, Right After Everyone Thought They Were Free

Ilya Sutskever, the researcher who built GPT-3’s architecture, said in late 2025 that the “age of scaling” is over.

From 2020 to 2025, the industry ran one recipe:

• more data

• more compute

• bigger model

• better result

It worked so well that, in his words, it sucked “all the air out of the room.”

Every lab did the same thing because it kept working.

Now compute is cheap enough that it’s not the constraint anymore.

New ideas are.

And here’s the part that stings: there are more companies than ideas by quite a bit.

A hundred startups, one thesis, copy-pasted.

If you’re building something and your pitch sounds like everyone else’s pitch, you don’t have a company.

You have a seat at a crowded table.

3/ Turing Award Winner Bet His Entire Legacy Against His Own Field (Bet Is Still Live)

Yann LeCun spent 12 years as Meta’s chief AI scientist.

In November 2025 he told Zuckerberg he could move faster outside, then left to build a company betting that large language models are a dead end for real intelligence.

His startup, AMI Labs, raised $1.03 billion in March 2026, the largest seed round in European history, backed by names like Nvidia and Bezos Expeditions.

As recently as this month, at a conference in Seoul, his co-founder was still making the same case:

LLMs don’t understand physical reality the way an embodied system needs to.

Here’s why this matters more than the drama.

LeCun has been early and right before, back when neural networks were a punchline.

He might be early and right again.

Or he might be the smartest person in the room chasing the wrong decade.

Nobody knows yet, including him.

The lesson is that the people building the actual frontier don’t agree on what the frontier even is.

Turing Award credentials do not buy you certainty.

If the inventors are split, you don’t need an opinion this week.

You need optionality.

4/ Efficient AI Doesn’t Cost Less (It Costs More)

GPT-4 to GPT-4o made inference roughly 100x cheaper.

Usage went up by roughly 1000x.

That’s not a rounding error, that’s the Jevons paradox doing exactly what it did to coal in 1865:

cheaper fuel doesn’t mean less burning, it means more machines built to burn it

Every time a model gets cheaper, the market doesn’t shrink to fit the old budget.

It expands to eat the savings and then some.

If your business plan assumes AI costs will flatten out and stay flat, you are planning for a world that has never once existed since ChatGPT launched.

5/ 95% Club Is Bigger Than The Hype Suggests (It’s Still True A Year Later)

MIT looked at 300 enterprise AI deployments in 2025.

95% percent delivered zero measurable P&L impact.

Not because the models were bad.

Because the tools were generic, brittle in real workflows, and couldn’t retain feedback or adapt to context.

Here’s the detail that should reshape your roadmap:

• buying from a specialized vendor and building a real partnership succeeded roughly 2x as often as building it in-house, alone.

• the highest ROI was in boring back-office automation nobody puts on a conference slide

By mid-2026, enterprise buyers had gotten sharper about it, not softer.

Surveys of IT decision-makers this year show direct financial impact nearly doubling as the metric companies actually hold AI to, while it saved us time fell out of favor as an excuse.

Uber burned through its entire 2026 AI tooling budget in 4 months and responded not by cutting AI, but by capping spend per tool per employee and tracking it on a dashboard.

That’s a company finally treating AI spend like a real budget line instead of a hype line.

Boring wins.

Flashy gets funded, then gets capped.

6/ Models Are Jagged (means predictable)

Karpathy has a phrase for why AI can write a working web app in one shot and then fail at something a 10-year-old could do: jaggedness.

Labs train these systems with reinforcement learning against things you can verify, math answers, passing unit tests, and benchmark scores.

So models get frighteningly good at anything with a clean scoreboard, and stay rough everywhere else.

Traditional software automated what you could specify.

This generation of AI automates what you can verify.

That single idea tells you where the next few years of automation land first.

• coding

• math

• structured compliance checks

• anything with a pass/fail signal

It also tells you where it lands last: judgment calls, nuance, taste, anything where two experts might reasonably disagree.

A 2026 study tracking over 100,000 GitHub developers found coding agents drove a 741% jump in lines of code and a 65% jump in pull requests, but actual shipped software releases only rose 20%.

The issue was humans reviewing, testing, and deciding what was safe to ship.

Verification didn’t disappear, it just moved to the reviewer’s desk.

7/ Agents Are Starting To Run Their Own Research (Semi-Unsupervised)

Karpathy built something he calls AutoResearch.

He let an AI agent run continuously for 2 days, testing changes to a small language model’s training process.

700 experiments later, it had found 20 optimizations that sped up training.

Applied to a slightly bigger model, those tweaks delivered an 11% speedup.

Shopify’s CEO tried the same approach on internal data overnight and got a 19% performance gain from 37 experiments.

Karpathy’s own description of where this goes next: spin up a swarm of agents, let them tune smaller models in parallel, promote whatever works to bigger and bigger scales, and let a human step in only at the edges, if at all.

Read that again.

If at all.

8/ English Became The Compiler

The hottest new programming language is English, Karpathy said and by now it’s not even a hot take, it’s just the weather.

Syntax stopped being the skill.

Prompting well, thinking clearly, and knowing what a correct answer looks like before you see it, that’s the skill now.

Which means the advantage shifts to people who were always good at clear thinking and bad at semicolons.

If you spent years feeling like the “non-technical” one in the room, this is your unlock.

If you spent years being the best at syntax and nothing else, this is your warning.

9/ 10x Engineer Became Something Bigger (Taste Is The Whole Gap)

For years people argued about whether a 10x engineer was a myth.

Karpathy’s take: agentic engineering doesn’t just confirm the 10x engineer, it blows past it.

The ceiling on what one well-directed person can ship went up by an order of magnitude nobody has fully measured yet.

But the floor also rose.

Anyone can generate a working prototype in an afternoon now, that’s vibe coding, and it raises the floor for everybody.

The ceiling only rises for people who add judgment on top:

• knowing what’s actually good

• what will break in production

• what to throw away

Raw output stopped being the differentiator months ago.

Taste is the differentiator now, and taste is exactly the thing you can’t prompt your way into.

10/ Software Stopped Being Built For Humans Clicking Buttons

Karpathy tells a story about building a home automation app.

The deeper point is that the most software exists because humans need a screen to navigate:

• menus

It lets websites expose their functions directly to agents, instead of forcing agents to guess at pixels on a screen.

Early numbers on it: close to 98% execution accuracy versus roughly 70% for agents that have to visually parse a page, with up to 89% fewer tokens burned doing it.

The next wave of valuable infrastructure won’t be user-native.

It’ll be agent-native.

Most founders are still building the old kind.

11/ Verifiable Industries Have A Shorter Runway Than They Think

Here’s a thought that should worry anyone in a safe regulated profession.

Traditional computers automated what you could code explicitly.

This generation automates what you can verify.

A lot of professions people assume are protected by complexity are actually protected by nothing more than the fact that nobody has built the verification loop yet.

Once someone builds it, the moat disappears fast, not gradually.

This cuts both ways for anyone building in energy, healthcare, defense, or law enforcement.

The domains without a clean scoreboard yet are exactly where deep domain expertise still beats a generic model, because nobody outside the industry knows what correct looks like well enough to build the reward signal.

That’s not a permanent moat.

It’s a lead.

Leads close.

12/ Industry’s Own Experts Can’t Agree On When, Or If, AGI Shows Up

Sutskever says the scaling era, and with it the old timelines, is over.

Geoffrey Hinton says scaling still has room to run because models will start generating their own training data.

Dario Amodei has said scaling alone gets us there.

Demis Hassabis gives AGI a 50% shot by 2030 and says push scaling as hard as possible anyway.

LeCun calls the entire premise complete bullshit, and this year Anthropic separately published research claiming to have found something like a structured internal workspace inside Claude, which reignited the same argument from the opposite direction.

These are not fringe voices.

These are the people who built the field, disagreeing in public, on the record, at the same moment in time.

Anyone in your feed who states a confident AGI date, in either direction, is doing marketing, not forecasting.

13/ Moat Was Never The Model

Open weights, cheap APIs, and shrinking price-per-token mean the raw model is becoming a commodity faster than most roadmaps account for.

What doesn’t commoditize as fast:

• the workflow it’s wired into

• the proprietary data it sees, the vertical-specific verification loop that tells it whether it got the answer right

• the trust built up with a regulated buyer who can’t afford a wrong answer

MIT’s own data backs this up sideways.

The pilots that worked were the ones wired tightly into a real back-office workflow, usually through a vendor partnership rather than a from-scratch build.

Whoever owns the workflow owns the customer.

Whoever only owns the model is one price cut away from irrelevance.

14/ Cheaper AI Is Making Some Jobs Disappear (Other Jobs Multiply At The Same Time)

The instinct is:

• AI gets cheaper

• companies need fewer people

• jobs vanish

That’s half the Jevons story.

The other half:

• enterprise AI bills have kept climbing even as per-unit cost dropped

• because falling prices unlocked entirely new use cases nobody was doing before

• data center construction alone is creating steady demand for electricians

• civil engineers, and facility managers who have nothing to do with prompting anything

The jobs that vanish are the ones sitting entirely inside a verifiable, narrow task.

The jobs that multiply are the ones adjacent to the infrastructure boom, or the ones requiring the judgment a model still can’t fake.

Same technology, two opposite outcomes, depending entirely on which side of the verification line your work sits on.

15/ Reputation For AI Agents Is A Harder Problem Than Reputation For Humans

If agents start transacting with each other, hiring each other, paying each other, you hit a wall humans never had to think about:

• an AI agent isn’t a fixed, continuous entity the way a person is

• it can be cloned in seconds

• its behavior shifts with a prompt change

• it has no memory once the context window closes, and it feels no cost when its reputation gets destroyed, because there’s no one home to feel it

Every mechanism that keeps human reputation systems honest

• the fact that a criminal record follows you

• the fact that a bad review costs you future business

• the fact that shame is a real deterrent, breaks down the moment the actor isn’t a continuous being

Researchers are now proposing staked collateral and cryptographic identity to patch this.

Nobody has solved it in production yet.

Whoever owns a piece of infrastructure that the entire agent economy will need.

16/ Vibe Coding Raised The Floor But It Didn’t Raise The Ceiling

Everyone’s excited about vibe coding because it made building look easy.

And it did make building look easy.

That’s the floor moving up:

a non-technical founder can now ship a working prototype over a weekend.

But agentic engineering, coordinating multiple agents while preserving professional-grade quality, is a completely different skill, and it’s the one that actually compounds.

Most people chasing the AI gold rush right now are optimizing for the floor.

Faster prototypes, more demos, louder LinkedIn posts about what they shipped in a weekend.

Very few are optimizing for the ceiling:

the judgment layer that turns a fast demo into something that survives contact with real customers, real edge cases, real regulatory scrutiny.

The floor is crowded.

The ceiling is nearly empty.

17/ Safest Word In AI Right Now Is Boring

Every pitch deck this year uses the same words:

• agentic

• autonomous

• transformative

MIT’s data says the actual money sits in back-office automation, the least glamorous category that exists:

• document processing

• internal workflows

• compliance checks

It got the least funding and the highest return.

And in 2026, enterprise buyers went further:

• they now hold every AI purchase to a P&L standard

• not a we saved some hours standard

If your pitch deck sounds exciting, that might be the problem, not the selling point.

Exciting pitches compete for the same investors chasing the same thesis.

Boring, verifiable, workflow-embedded problems compete for almost nobody.

18/ Nobody Agrees And That Disagreement Is The Actual Opportunity

Step back and look at what you just read.

The co-founder of OpenAI felt so behind that he went back inside a lab.

The architect of GPT-3 says the entire recipe that built GPT-3 is exhausted.

A Turing Award winner staked his legacy on the opposite bet from everyone still funding LLMs at scale, and a billion dollars says he might be right.

95% percent of enterprise pilots using the current technology still produce nothing, a full year after that number first got published.

That’s an industry where the map hasn’t been drawn yet, and the people usually paid to draw it are openly arguing about which direction is north.

Every genuinely early market looks exactly like this from the inside:

• confusing

• contradictory

• and full of very smart people who are all convinced they’re right

Do This On Monday

Pick one thing you’re building or selling and run it through 4 questions:

• Does it live in a domain with a clean scoreboard (verifiable), or a domain with no scoreboard yet (judgment)? That tells you your real timeline before you get automated or before you get an opening.

• Is it wired into someone’s actual back-office workflow, or is it a shiny demo sitting next to their workflow? MIT already told you which one gets funded and which one gets forgotten in six months.

• Are you optimizing the floor (how fast you can prototype) or the ceiling (the judgment layer nobody can copy)? Pick one on purpose instead of drifting into whichever one felt easier this week.

• If the smartest people in this field can’t agree on the next eighteen months, what are you doing holding a strong opinion about the next five years? Build for room to change your mind, not for a forecast.

None of this is settled.

That’s the whole point.

Thank you for showing love to the AI Engineer Roadmap. I created another roadmap for AI Agents along with design patterns.

40% of agentic AI projects will be cancelled by 2027.

Gartner said it.

Not because the models are weak.

Because most engineers are building demos that die the moment they meet production.

Here’s the pattern.

Someone connects a tool, calls an API, prints the response, calls it an agent.

It works in the notebook. It passes the eval. The demo goes great in the all hands.

Then a tool call returns malformed JSON.

The agent doesn’t crash.

It doesn’t alert anyone.

It just keeps going with corrupted context, confidently, like nothing happened.

That’s the gap this roadmap closes.

A script that calls an API is not an agent.

It’s a function call wearing a costume.

A real agent reasons about what to do next.

It acts on that reasoning.

It observes what happened.

It corrects itself based on what it saw.

If your system can’t survive corrupted context, malformed schemas, and an indirect prompt injection hidden inside a document it was just asked to summarize, it will not survive contact with reality.

This is the exact roadmap to build systems that survive.

How this roadmap is built

Each phase has the same 4 part structure.

Goal
What you can do at the end of this phase that you couldn’t do at the start.

Modules
Topics, broken down with the failure mode each one prevents, not just the name of the technique.

Tech stack
Real frameworks and tools people are using in production right now, not a generic list.

Artifacts
what to build, and exactly what each artifact forces you to confront.

Don’t skip the “why it matters” lines.

Most roadmaps give you a list of terms to learn.

This gives you the list and the reason each one earns its place.

Because the reason is what you’ll actually remember six months from now when something breaks at 11pm.

PHASE 1 - FOUNDATIONS

Goal - Single-Agent Reliability

If you can’t make one agent bulletproof, you have no business orchestrating 5 of them.

Everything in Phase 2 assumes you’ve already internalized everything here.

Skipping this phase is the single most common reason multi-agent systems collapse later.

[Module 1] Cognitive Core

ReAct Loop (Thought, Action, Observation)

This is the heartbeat of every agent you will ever build.

The agent thinks about what to do. It takes an action. It observes the result. It thinks again based on that result.

If you don’t understand this loop well enough to explain it to a non-technical friend, stop here and go back.

Everything downstream, routing, memory, multi-agent orchestration, is just this loop running at scale.

Tool Mechanics and Schema Enforcement

An LLM doesn’t directly call your functions.

It outputs a structured request based on a schema you define, and your code executes the actual call.

This sounds simple until a routine dependency upgrade silently changes how that schema gets generated.

In early 2026, this exact thing happened to a popular workflow automation tool.

The new schema format was rejected by different model providers with different error messages, and production workflows simply stopped working. Nobody caught it before it hit users.

Learn to validate schemas before execution, not after something breaks.

Structured Output with Pydantic

Raw text output from an LLM is fragile.

The model might phrase a number as “approximately 40” one time and “40ish” the next.

Typed, validated output forces consistency.

It’s the only way anything downstream of the model can be trusted to work without a human checking every response by hand.

[Module 2] Control Flow and Context

Routing and Parallelization

Not every request needs the same handling.

Routing means classifying intent first and sending different types of requests down different paths, each with the right tools and the right prompt for that specific job.

Parallelization means recognizing when two sub-tasks don’t depend on each other and running them at the same time instead of one after another.

The failure mode to watch for: one of four parallel branches times out silently, and the step that combines results never finds out it’s missing a quarter of its input.

Prompt Chaining vs. Context Engineering

Prompt chaining is simple. One model call’s output feeds the next call’s input, in a fixed sequence.

It’s a fine starting pattern, but it has a quiet failure mode. An error in step two gets trusted completely by step three, with nothing catching that step two was subtly wrong.

Context engineering is the bigger discipline this leads into. It’s the actual skill that matters in 2026.

Prompting optimizes what you say to a model in a single turn.

Context engineering decides what the model is even allowed to see at every step of a multi-step task.

It treats every token in the context window as a budget that has to earn its place.

This is the skill that separates someone who can build a working demo from someone who can build something that survives a long-running task without quietly drifting off course.

Tech Stack

Python, LangChain (LCEL), OpenAI / Anthropic / Gemini APIs, Pydantic, FastAPI, Docker, Git, Pytest

Artifacts

1/ Structured Data Extractor

• Take messy, unstructured text (a contract clause, an email, a support ticket) and run it through a reliable pipeline that outputs validated, typed data every single time.

• No agent autonomy yet.

• This artifact is purely about reliability.

• If you can’t get consistent structured output from a single call, you’re not ready for a loop that makes five calls in sequence.

2/ Dynamic Service Router

• A FastAPI service, fully Dockerized, that classifies incoming requests by intent and routes each one to the correct specialized ReAct loop.

• Write real tests with Pytest.

• If you skip containerizing and testing this, you’ve built a notebook, not a portfolio piece.

• This is also the first artifact where you’ll personally feel the cost of a misclassified request, which is exactly the lesson it’s designed to teach.

PHASE 2 - SCALE

Goal - Multi-Agent Orchestration & Persistent Memory

This is where most tutorials stop and where production engineering actually begins.

The center of gravity in agent engineering moved here in 2026.

Multi-agent orchestration went from “interesting experiment” to “the default enterprise ask.”

[Module 3] Multi-Agent Orchestration Patterns

The rule before the patterns.

There are exactly 3 legitimate reasons to use more than one agent.

1. Task exceeds a single context window

2. Task is too complex for one model to handle reliably end to end

3. Serial execution is too slow and the sub-tasks genuinely don’t depend on each other

If none of these are true for your problem, a single well-architected agent will likely outperform a poorly-orchestrated multi-agent system.

There’s real benchmark evidence for this.

Single-agent architectures have beaten multi-agent ones by avoiding coordination overhead entirely.

Don’t reach for a swarm because it sounds impressive in a demo.

Reach for it because the problem actually demands it.

6 production orchestration patterns

Each one comes with a specific failure mode that shows up in real systems.

1. Sequential Chains
   
   Agent A’s complete output becomes Agent B’s input, in strict order.
   
   Failure mode: an error doesn’t just pass through, it compounds, because each step is a full agent that might loop or fail internally before passing anything downstream.
   

2. Parallel Fan-Out
   
   Multiple agents work the same problem from different angles, results get merged.
   
   Failure mode: two agents return contradictory conclusions and nothing in the system is designed to resolve the disagreement, so the merge step picks one arbitrarily.
   

3. Supervisor/Worker
   
   The most common production pattern. One orchestrator delegates to specialist workers and assembles results.
   
   Failure mode: the supervisor’s own context window fills up trying to track every worker’s full output.
   
   Fix: workers return concise structured summaries, not raw transcripts.
   

4. Hierarchical Delegation
   
   Nested supervisors for problems too complex for one flat layer.
   
   Failure mode: two agents operating from different definitions of the same term produce a conflict no supervisor in the hierarchy can resolve, because the disagreement happened below the level anyone was watching.
   

5. Consensus / Debate
   
   Multiple agents independently produce a position, then argue or vote to reach a conclusion.
   
   Failure mode: groupthink if every agent is the same model with the same biases, or deadlock if there’s no tie-breaking rule.
   

6. Human-in-the-Loop
   
   The system pauses at a defined checkpoint for a human decision.
   
   Failure mode: “we have a human review option” that exists on paper but never actually fires, because the confidence threshold was never tuned.
   

The six patterns are the skeleton. What kills agents in production is what happens inside each one.

Context drift. Memory architecture. How to evaluate what you cannot see. How to defend what you cannot lock.

Solving Context Drift

This is the failure mode nobody explains well in most courses.

Context drift isn’t caused by running out of context window space.

It happens because information sitting in the middle of a long accumulated context gets attended to less reliably than information at the start or end.

That’s a property of how attention behaves over long sequences, not a bug you patch with a bigger window.

The agent doesn’t error out. It just slowly stops doing what it was originally asked to do, and nobody, including the agent, notices the departure.

Fixes: hierarchical summarization instead of raw accumulation, explicit goal-state pinning that the agent re-reads at intervals, and active context pruning instead of passive accumulation.

Inter-Agent Protocols - MCP and A2A

MCP standardizes how agents connect to tools and external data sources, so you’re not hand-building a custom integration for every tool you add.

A2A standardizes how agents from different frameworks and vendors talk to each other.

You don’t need to memorize the spec.

You need to understand why a standard matters the moment you have agents on different stacks that need to cooperate without someone hand-writing a translation layer between every pair.

One security note worth carrying into Phase 3 already: MCP’s rapid adoption has come with real, documented authentication gaps in production-grade connectors, including from major vendors.

Treat “it’s a standard” as a different claim than “it’s secure.”

[Module 4] Memory Architecture

The rule before the frameworks.

Memory is not just a vector database.

In 2026, production memory is treated as a dedicated architectural component, separate from the context window.

It does 3 distinct jobs:

1. extracting facts from interactions

2. deciding what gets stored where

3. and retrieving only what’s relevant at the right moment instead of dumping everything back into the prompt

3 memory types:

• Episodic
  Specific past events. “The user asked about pricing on March 3rd.”
  

• Semantic
  General facts learned over time. “This user prefers concise answers.”
  

• Procedural
  Learned skills or successful strategies for recurring task types.

Storage layer logic

Vector databases are excellent for semantic similarity but weak at multi-hop relational reasoning. “Who reports to whom and who worked on what with whom” is not a similarity problem.

Graph databases are strong at relationship traversal and temporal reasoning, which makes them the better fit for episodic and procedural memory.

Most serious production systems in 2026 combine both rather than picking one.

Frameworks, and why they aren’t interchangeable

• Mem0
  
  The easiest managed drop-in for personalization memory, strongest community and compliance posture.
  

• Zep (Graphiti engine)
  
  Wins decisively on temporal reasoning benchmarks.
  
  The right call if “when did this happen relative to that” matters to your use case.
  

• Letta
  
  OS-inspired tiered memory, treating active context like RAM and everything else like disk.
  
  Well suited to long-running agents managing their own context budget.
  

Tech Stack - Phase 2

LangGraph (state machines, checkpointers), CrewAI, AutoGen, Vector Databases (Weaviate, Pinecone, ChromaDB), Neo4j, Mem0, Zep, Letta, MCP, A2A protocol, LiteLLM

Artifacts

3/ Hierarchical Research Crew

• A Project Manager agent breaks a broad topic into sub-tasks, delegates to specialist research agents running in parallel, and a synthesis agent combines everything into one report.

• This is your first real test of supervisor/worker orchestration, and the first place you’ll personally feel context drift if you’re not deliberate about what each sub-agent actually needs to see versus what it’s accumulating unnecessarily.

4/ Memory-Backed Query Router

• Extend Artifact 2 into a system that classifies queries by complexity, routes to the cheapest model that can actually handle each one, and remembers user context across sessions using a real vector-plus-graph memory layer, not chat history pasted back into the prompt.

• Log your cost and latency savings explicitly.

• This artifact proves you understand resource-aware design, the difference between an engineer who can build an agent and one who can run a budget.

PHASE 3 - PRODUCTION

Goal - Security, Evaluation, and Governance

This is the unglamorous phase almost nobody builds a portfolio piece around.

It’s also the phase that decides whether your agent survives or ends up in the 40% that gets cancelled.

[Module 5] Agentic Evaluation Systems

3-level eval hierarchy

Most teams only build one of these levels.

That’s the mistake.

1. End-to-end
   Did the task actually succeed, by whatever definition of “done” the task requires.
   

2. Trajectory
   Was the path taken efficient and sound, or did it succeed despite looping, retrying, or getting lucky.
   

3. Component
   When something breaks, which specific piece broke.
   
   The retriever, the router, a particular sub-agent.

An agent can call every tool correctly and still fail the task.

It can also technically complete the task while looping inefficiently in a way that bankrupts your API budget at scale.

You need all 3 levels to actually debug a production system instead of guessing at it.

LLM-as-Judge - where it’s useful, and where it lies

Using a model to grade another model’s output is fast and scales well.

It’s also blind to looping, blind to tool-call correctness, blind to recovery behavior. It only ever sees the final output text.

Pair it with deterministic checks (did the tool call use valid syntax, did the output match the schema) for anything with an objectively correct answer.

Reserve the judge model for the genuinely subjective parts.

Online vs. Offline Evaluation

Offline evaluation runs against a held-out test set before you deploy. It tells you how the agent does on tasks you already anticipated.

Online evaluation scores real production traffic as it arrives. It’s the only way to catch the failure modes you didn’t anticipate.

The practical constraint: LLM-as-judge is too slow and expensive to run on every single turn.

Production systems sample a percentage for expensive judge scoring and run fast deterministic checks on everything else.

[Module 6] Security and Governance

Lethal Trifecta

An agent becomes a serious security liability the moment all 3 of these are simultaneously true.

• It can read untrusted content (a webpage, an email, a document it didn’t generate)

• It has access to sensitive data

• It can communicate externally

Remove any single leg and most injection attacks stop working.

This is the highest-leverage question to ask before granting any new permission: does adding this capability complete the trifecta.

Prompt Injection - Direct and Indirect

Direct injection is a user typing adversarial instructions straight into a prompt.

It’s easier to defend because you control the input boundary.

Indirect injection is far more dangerous and far less understood.

Instructions get hidden inside content the agent processes as data: a document, an email, a webpage.

The agent follows them as if they came from its actual principal.

This is not theoretical.

Documented incidents in 2026 include enterprise AI assistants tricked via a single crafted email, with zero user interaction required, attempting to exfiltrate data through what looked like a trusted channel.

If your agent reads anything it didn’t generate itself, that content is now part of your attack surface.

Human-in-the-Loop, designed properly

“We have a human review option” in a footnote is not a HITL system.

A real one has a tuned confidence threshold deciding what auto-approves versus what queues for review.

It has an actual interface a human uses to act on that review.

It has a complete audit log of what happened and when.

Run the cost math before assuming more automation is always better.

A missed compliance issue typically costs orders of magnitude more than a handful of unnecessary human reviews.

The math usually says review more than instinct suggests.

Tech Stack - Phase 3

LangSmith, Arize Phoenix, Braintrust, DeepEval, Ragas, W&B Weave, Llama Guard, Nvidia NeMo Guardrails, Presidio, FastAPI, Docker, Pydantic

Artifacts

5/ Eval Harness

• Build a continuous evaluation pipeline that runs against one of your earlier artifacts on a schedule, tracking task completion and trajectory quality over time, and alerting when a metric drops below a threshold.

• This artifact proves you’re thinking like the engineer who watches the system, not just the one who built it once and walked away.

6/ Guarded Financial Agent

• Take an earlier artifact and add a complete security and governance layer: input sanitization against injection, scoped tool permissions following least-privilege (give each agent the bare minimum access its job needs), a human approval gate for any action above a defined risk threshold, and full audit logging.

• Simulate an actual attack against your own agent and document exactly what happened.

• More than any other artifact on this roadmap, this is the one a serious hiring manager will read closely, because it proves you’ve thought about what happens when something goes wrong, not just what happens when everything goes right.

PHASE 4 - FRONTIER

Goal - Systems That Optimize Themselves

This phase is optional for getting hired.

It’s not optional if you want to be in the top 1%, not the top 10%.

[Module 7] Autonomous Optimization

Self-Improving Agents - the Generator-Reflector-Curator loop

A 3-role pattern.

• A generator produces a response or trajectory.

• A reflector evaluates and refines it, catching errors and adding missing context.

• A curator extracts what was learned and updates a persistent “playbook” the agent reads on its next run.

No fine-tuning of model weights required.

This has shown real, measurable gains on agent benchmarks purely through better context engineering, the logical endpoint of everything in Module 2.

Tree-of-Thought (ToT)

Instead of one linear chain of reasoning, the agent explores multiple paths and picks the strongest one.

Useful when a problem has several genuinely plausible approaches and committing to the wrong one early is expensive to undo.

Autonomous Exploration

Agents that don’t just execute a task you handed them.

They generate their own hypotheses, test them, and refine their own logic based on what they find.

This is the closest thing on this roadmap to a research assistant rather than a task executor.

It’s genuinely frontier work as of 2026.

LangGraph (dynamic graph building), advanced reasoning models, Knowledge Graphs, cloud GPU infrastructure for self-evaluation loops

Phase 4 Artifact

7/ Adversarial Debate System

• Two agents, a Proposer and a Skeptic, debate a technical strategy for a fixed number of rounds, producing a synthesized, validated conclusion with every point of agreement and disagreement explicitly logged.

• This artifact does double duty.

• It teaches consensus/debate orchestration directly, and the debate transcript itself becomes one of the most interesting things you can show in an interview, because it’s not a feature demo, it’s a decision-making process made visible.

Reliability Checklist

Before you call yourself an AI Agents Architect, your system needs to pass every line of this.

Each one maps to a documented, real failure mode covered somewhere above, not a hypothetical edge case.

• every tool call is validated against a schema before execution, never assumed correct

• tool failures have explicit recovery handling, no silent continuation on corrupted context

• hard iteration caps exist on every loop, with explicit repetition detection, no infinite billing cycles

• context is actively pruned and summarized on long tasks, not passively accumulated

• original goal state is pinned somewhere the agent re-reads, not just stated once at the start

• memory is a distinct architectural layer, separate from the context window, with an explicit decision about what’s stored short-term vs. long-term

• evaluation happens at all three levels: end-to-end, trajectory, and component

• at least some percentage of production traffic is scored online, not just tested offline before launch

• no agent simultaneously reads untrusted content, holds sensitive data access, and can communicate externally without a mitigating control

• every tool permission is scoped to the literal minimum that agent’s job requires

• high-risk actions have a real, tuned confidence threshold gating human approval, not a footnote that says “review available”

• every agent decision is logged: what triggered it, what it retrieved, what it output, whether a human reviewed it

If you can’t check every box, you don’t have a production agent.

You have a very convincing demo.

Do this Monday

If you’ve never built an agent: start with Artifact 1.

Get comfortable with reliable structured output before adding any autonomy at all.

If you’ve built one agent that mostly works: skip to Artifact 3.

The moment you coordinate two or more agents, you’ll feel context drift for the first time, and that’s worth more than reading about it.

If you’ve already shipped a multi-agent system: go straight to Artifact 6.

Most engineers never build the security layer until something forces them to.

Build it now, on purpose.

And he’s the one with a paid client and a system running in production.

You’re still collecting certificates.

Meet Alex Ariza Herrera.

He is a full stack developer in Colombia, South America.

8 weeks ago he had zero AI experience.

• No AI job

Problem with 99% of AI Courses

Here’s the part that should bother you if you’ve ever paid for an AI course.

Alex looked everywhere before finding this one.

I couldn’t find anything that covered applied AI end to end. Every course I found mixed in machine learning theory and deep learning fundamentals and never once landed on a real, deployed project.

You can watch a hundred YouTube videos on transformers.

You can finish a Coursera specialization.

Local language models hallucinate.

They underperform.

He had to completely rework his ranking and evaluation logic just to get the retrieval accuracy to a usable state.

But watch what he did next, because this is the skill that got him paid.

He didn’t run to the answer key.

He didn’t ask for someone to fix it.

He built a hypothesis, tested it, broke it, and fixed the bug himself.

Only then did he check his work against the MasterDexter codebase.

Most bootcamps produce students who can follow step-by-step instructions.

Before: no AI job, no AI project, no AI experience.

That log of bugs you solved yourself is worth more to a CTO or a client than any university certificate.

It proves you can survive contact with reality.

They warn you about the technology.

The technology is the easy part.

Here’s what they don’t warn you about.

• you inherit 10 AI pilots and nobody can tell you which ones are doing anything useful

• your CFO asks what the ROI on the AI program is, and you don’t have a real answer

• your team is split on LangChain versus LangGraph, and you can’t referee that argument with confidence

You find out someone on your team has been pasting client data into ChatGPT for three months, and you have no plan for it.

AI Leadership Accelerator [Founding Cohort]

AI strategy for people who make real decisions.

You have 17 AI pilots running.

Maybe more.

Some started 6 months ago, some last quarter.

A few show promise.

Most are just burning money while your team waits for “more data” or “the next iteration.”

Here’s the uncomfortable part.

You already know which ones are dead.

You just haven’t admitted it yet.

88% of AI pilots never make it to production.

That number doesn’t move much depending on which research you read.

The graveyard isn’t full because the technology failed.

It’s full because nobody had the guts to pull the plug when it mattered.

You ask for an update and get back polite lies wrapped in technical language.

We’re seeing promising signals.

Just need another sprint to validate the approach.

Early results are encouraging.

None of it means anything.

It’s cover for a team that doesn’t want to admit it’s stuck.

And the team usually isn’t the problem.

Nobody defined what success looked like before the pilot started, so now you’re measuring progress against a target that keeps moving, while your CFO asks why AI spend is up 40% with zero revenue to show for it.

You need a framework that forces honesty instead of hope.

One that strips out the optimistic language and looks at 2 things only:

1. business value

2. how hard this actually is to ship

Matrix

Forget scoring systems with 40 criteria.

You need something you can run in an afternoon.

Value isn’t what the data science team finds interesting, and it isn’t what won an award at a conference last year.

Real value means one of four things:

1. it makes money

2. it saves money you can measure in dollars

3. it builds a moat

4. or it prevents an expensive failure

If you can’t say the dollar impact in one sentence, it’s Low.

Be ruthless.

Complexity is not about how smart the model is.

It’s whether you actually have the data or you are “still working on access.”

It’s how many legacy systems need to talk to this thing.

It’s whether Legal and Security will sign off or find reasons to stall for another quarter.

It’s whether your current team can build and maintain this, or you need three unicorn hires you don’t have budget for.

One disaster-waiting-to-happen factor is enough to make the whole pilot High Complexity.

Plot every pilot on those two axes and four categories fall out.

1/ High value, low complexity (Scale immediately)

An insurance company had a pilot using AI to auto-categorize customer support tickets.

Saved 15 hours a week.

Used data they already had.

Integrated with existing systems in days.

They were still “testing” it after four months.

Why? Nobody had the authority to just ship it.

If you’ve got a Quick Win sitting in pilot purgatory, you don’t have a technology problem.

You have a decision-making problem, and that’s a worse one.

2/ High value, high complexity (Pivot to phases, don’t kill, don’t pretend)

A retail company wanted AI inventory prediction across 200 stores.

Way too complex to start there.

So they didn’t.

They started with 5 stores, proved the model worked, fixed the integration approach, then scaled.

18 months instead of 36, and they learned what actually mattered along the way instead of guessing for three years.

These need an executive sponsor and a multi-quarter commitment.

If you can’t get both, move it to the parking lot and stop pretending it’s six months out.

3/ Low value, low complexity (Pause, don’t pretend it’s a priority)

Easy to build.

Nobody asked for it.

Someone will call it low-hanging fruit.

If the fruit doesn’t matter, stop picking it.

Revisit in 6 months if priorities shift.

More likely you’ll forget it existed, and nothing bad will happen.

4/ Low value, high complexity (Kill it today)

These are the zombies.

Hard to build, unclear value, burning budget and morale while everyone pretends otherwise.

Your VP of Innovation championed one of these.

Your data science lead has spent eight months on it.

The team keeps saying they’re close to a breakthrough.

They’re not.

They’re stuck, and every week you wait costs you money and credibility with the people watching you run this.

Score it, don’t eyeball it

High and Low gets you most of the way, but the close calls need numbers.

Run this on each pilot:

4 points for revenue or cost impact you can quantify, 3 for strategic importance, 3 for time saved.

That’s Value, out of 10.

Then Complexity, also out of 10:

3 points for how messy the data is, 3 for how much rearchitecting you’d need, 2 for whether your current team can actually own this, 2 for compliance risk.

Value 8 to 10 with Complexity 0 to 3, ship it now.

Value 8 to 10 with Complexity 4 to 10, that’s a Big Bet, commit fully or kill it.

Value 4 to 7 with low complexity, pause it.

Anything low value with high complexity, kill it, no exceptions.

Here’s what that looks like with real pilots.

Say you’re in automotive finance, three on the table:

• AI loan default prediction (A)

• Dealer inquiry chatbot (B)

• Tool that reads scanned income proofs and auto-fills the application (C)

Default prediction lands as a Big Bet.

Worth building, but compliance sign-off on anything touching credit decisions is real friction.

Start with a tool that flags risk for underwriters instead of replacing their judgment, prove it’s accurate, then push deeper.

The chatbot is a Maybe.

Cheap to build, but a status bot solves a problem a better dealer portal or an SMS trigger solves just as well. Pause it.

Document auto-fill scores 7 on value and 8 on complexity.

Kill it or reframe it completely.

Scanned document quality varies wildly, OCR errors on income data create compliance exposure, and you’d need a human checking every output anyway.

If you still want this, start with one document type, one region, a human in the loop on every result.

Two things worth noticing.

Complexity is added up on purpose, so one disaster factor, say Compliance Risk hitting 2, can’t get hidden behind clean data elsewhere.

And the pilots that land 6 to 8 on both axes are the most dangerous ones in your portfolio.

They feel viable.

They generate endless “just one more sprint” conversations.

Score them anyway.

The number cuts through the optimism faster than any meeting will.

Someone in the room will say you can’t kill it, you already spent $200K.

You’re about to spend another $200K.

The past spend is gone either way.

The only question that matters is whether future investment is justified by what you’d actually get back.

Most of your pilots will die.

Not because your team failed, but because most ideas don’t work, and that’s normal.

The companies winning with AI right now aren’t the ones with zero failures.

They’re the ones who spot the failures fast and move the budget to what’s actually working.

So stop protecting pilots that should die.

Stop saying you need more data when you already know the answer.

Stop hiding behind “strategic importance” when what you mean is you don’t want to admit this was a mistake.

Run the audit. Make the calls. Move on.

Your board doesn’t care how many AI pilots you launched.

They care how many shipped and made money.

Signal VS Noise · Issue 01

Every week, the internet throws 50 hot takes at you about AI. Most of it is noise. Hype, fear, recycled opinions. Signal vs. Noise series is where I cut through that. One clear idea per issue. Something you can actually use.

The skills that die are the ones AI can be trained on.

The skills that survive require a life to develop.

Everything below is in the second group.

Everyone around you is learning the wrong thing.

They are downloading new AI tools every week, taking prompt engineering courses, and refreshing their LinkedIn with AI enthusiast in the bio.

And they are going to get replaced anyway.

Not because they were lazy.

Because they were running in the wrong direction.

Here is the truth nobody says out loud: the tool is not the advantage.

A thousand people have the same Claude, the same Cursor, the same Gemini.

The tool is table stakes now.

What separates you is what YOU bring that the tool cannot.

And that gap is real.

It is specific.

And it is still very much yours to own.

[Skill 1] Agency

Agency means you see something that needs to happen and you make it happen.

No one assigns it.

No one permits you.

You just start.

In my sessions at AI Accelerators, I see this constantly.

Everyone has access to Claude Code.

Everyone can build now.

The person who wins is not the smartest person in the room.

It is the person who picks an idea on Monday and has a working version by Wednesday.

Speed is part of agency.

Not perfection.

Movement will beat the competition.

Here is a framework that I show in my AI Leadership & AI Engineering Accelerators:

Problem > Insights > Learning > Output > Traction

I explained it in detail in my EdTech 3.0 article.

How to build it fast:

• pick one idea this week

• ship in two days, even its broken

• show one person

that loop, done ten times, rewires how you work.

[Skill 2] Judgment

Judgment is knowing which idea is worth building before you spend six months on it.

I worked on a citation verifier for legal platforms because a company reached out to us.

I researched what problems they were solving, listed the gaps, and found one that companies would actually pay to fix.

That is judgment.

Not gut feeling.

Research + decision.

When AI makes building easier, bad judgment gets expensive faster.

You can now build the wrong thing in two days instead of two months.

The cost of a wrong call is multiplied.

I spent 4 months building something at Dextar that nobody paid for. The judgment check I use now came directly from that mistake.

How to build it fast:

• before starting any project, answer three questions

  • is this a real problem?

  • will someone pay to solve it?

  • can I validate it in a week?

If you cannot answer all three, keep thinking.

[Skill 3] Taste and Perspective

You have seen AI-generated websites.

You can tell in three seconds.

They are technically fine and completely flat.

Taste is the ability to look at something and know when it is off, even before you can explain why.

It comes from your experience.

Your five years in energy, or healthcare, or logistics. Your failures.

Your specific context.

Nobody else has that combination.

Perspective is the real-world lens you apply to any AI output.

I can ask Claude to write a case study on sales automation.

It will write an average one.

If I write it from the actual project I ran for a client, with the real challenges and the architecture changes and the third version that finally worked, it becomes something Claude cannot touch.

This is actually one of the first things we audit before touching any AI implementation at Dextar. A technically correct output that feels wrong destroys trust faster than a bug does.

How to build it fast:

• convert your experience into text

• write down what you know

• your learnings, your failed approaches, your specific domain knowledge

• store it, feed it into your AI tools as context

That is how your perspective becomes your unfair advantage.

[Skill 4] Deep Generalism

The best coder in the room can now be replaced by Claude Code.

That is not a prediction.

That is what is happening.

What cannot be replaced is the person who understands coding + marketing + how to talk to a client + how to price the work.

That combination does not exist in any single AI model.

You have to build it yourself.

You do not need to be an expert at everything.

Functional across four or five domains, sharp on one or two.

That is the combination that lets one person do what used to take a team.

Basically jack of all, or showing whats your range is?

How to build it fast:

• add one new domain this quarter

• if you are a coder, spend 30 minutes a day reading about sales

• if you are founder learn to create content

• not courses, real examples, case studies

Your breadth becomes your edge.

[Skill 5] Storytelling

AI writes clean sentences.

It rarely moves anyone.

A feature list gets ignored.

A story about a real problem, solved by a real person, with real friction along the way gets shared.

People do not remember information.

They remember how something made them feel.

If you can make a stranger care about your work in 30 seconds, you have a skill that compounds for the rest of your career.

MrBeast has 450 million subscribers. But a perfectly structured educational channel in the same category has 3,000. Same platform, same tools, completely different result. The variable is not quality. It is story.

This is something I am also working on with small steps, like cracking jokes, reading the room's energy, and saying something to practice storytelling.

How to build it fast:

• take one thing you built or solved this week

• write it as a story

  • what was the problem

  • what did you try first

  • what failed

  • what finally worked

  • post it

Do that every week for 30 days.

Your ability to communicate will double.

Remember: doubles play a significant role in compounding.

[Skill 6] Learning How to Learn

Coding nearly disappeared as a high-value career in 18 months.

Graphic design is on the same path.

The skill that pays well today may be worth half as much next year.

The people who keep winning are not the ones with the most knowledge right now.

They are the ones who can drop old knowledge fast and pick up new knowledge faster than everyone else.

If you can walk into a new domain and be functional in 30 days, you compound faster than any specialist.

That ability is worth more than any single certification.

How to build it fast:

• whenever you use a new AI tool, do not just use it

• understand what it is doing and why

• read one paper or one deep post per week outside your main domain

• build something with it

Learning by building is 10 times faster than learning by watching, obviously!!

[Skill 7] Real Network of Human Relationships

Not LinkedIn connections.

Not follower counts.

Actual trust with actual people.

One introduction from someone who genuinely believes in your work can open a door that 200 cold messages never will.

AI can draft the message.

It cannot build the trust that makes someone say yes to something new and uncertain.

In a world where everyone can produce the same output, who you know and who trusts you becomes rarer and more valuable every year.

One conversation with a CTO led to the first serious client for Dextar. No campaign. No funnel. Just a person who trusted what I built and made one introduction. That one call was worth 6 months of LinkedIn posts.

How to build it fast:

• pick 3 people in your network this week

• not to ask for anything

• just to share something useful with them

• a resource, an observation, a connection they might want

Do that consistently for six months.

Watch what happens.

The skills that get replaced are the ones a model can be trained to do.

The skills on this list require a life to develop.

They cannot be downloaded.

Most people will skip them because they are slower and harder than learning a new tool.

That is exactly why they are worth building.

BUILDER’S LOG · Issue 01

Builder’s Log is where I build AI products in real time. No filters, no theory. Just what I am doing, what I decided, and what happened. If you want to watch someone build an AI company from the inside, this is the series for you.

Most people spend weeks validating a product idea.

They build surveys.

They post in Facebook groups.

They talk to 10 people who say “yeah, sounds cool” and then never buy.

I did it in one afternoon. With three AI tools and one very specific question.

Here is what I did, step by step, with the actual prompts.

The idea I was trying to validate

I had been thinking about AI filters as a service.

Basically, before any query hits a large language model, there is a filtering step.

It checks for prompt injections, compliance issues, domain-specific rules.

These filters are usually built with small language models.

You can find these filters in any high-fidelity LLM inference architecture pipeline.

The insight was this:

every company using AI needs these filters. But nobody is offering them as a plug-and-play API. You either build them yourself or you skip them and hope nothing breaks.

So the question was, is this a real problem?

Or is it a “sounds cool, nobody pays for it” problem?

That is what I needed to find out fast.

[Step 1] Gemini for deep research

First I went to Gemini in deep research mode.

I did not just type “tell me about AI compliance filters.”

That gives you a Wikipedia article. Useless.

Instead I gave it real context.

I explained the idea, what I was thinking of building, who I thought the customers were, how big the market might be, and what existing players are doing.

Then I asked it to do a full competitive analysis, list the use cases, identify the gaps, and tell me what problems the biggest companies in the space have not solved yet.

The prompt looked something like this:

“I am thinking of building something called AI filters as a service. Small language models trained on specific compliance domains, offered as an API for any LM inference pipeline. Here is my thinking [context]. Do a detailed research on this. What is the industry size? Who are the big players? What are the biggest unsolved problems? What can I build that they will be ready to buy?”

Gemini came back with a real document. Not perfect, not gospel. But a starting point with actual structure.

The key thing to understand about AI research: it gives you answers to the questions you ask.

If you ask a random question, you get a random answer.

Context is everything.

The more specific you are, the more useful the output.

[Step 2] Grok for real-time Twitter(X) signal

Gemini gave me a research document.

But that research was based on training data, not what is happening right now.

So I took that document to Grok.

Grok has direct access to Twitter.

That means real conversations, real complaints, real people talking about their actual problems in their actual words.

This is the data no market research firm has.

I asked Grok whether anyone was building this already, whether the idea was getting any traction publicly, and what the community was actually saying about AI compliance in legal, healthcare, and enterprise contexts.

What you are looking for is signal.

Is anyone frustrated about this?

Is anyone asking for it?

Or is it completely silent?

[Step 3] Claude for synthesis and product strategy

Now I had two things: a deep research document from Gemini and real-time signal from Grok.

I pasted both into Claude and asked one question.

“Based on everything here, what exact product should I build, who will buy it, and which problem is so painful that they cannot build it themselves?”

Claude came back with 4 specific product ideas.

I did not stop there.

I pushed further.

I asked Claude to analyze which of the four the target company was least likely to build internally, based on their public blog posts and existing product decisions.

It looked at their writing, their priorities, and where their attention was going.

The answer was a hallucination citation verifier for legal AI platforms.

• Not for individual lawyers

• For the platforms those lawyers use

• the B2B infrastructure play, enterprise grade, API first

That is the product I decided to build.

Why this workflow works

Each tool does one specific job.

Gemini is the researcher.

It has strong analytical structure and deep synthesis.

Use it when you need a comprehensive picture of a space.

Grok is the street reporter.

It has access to what people are saying right now, today, on Twitter(X).

Use it when you need real-time signal before the market research firms even know a trend exists.

Claude is the strategist.

It is best at taking complex, messy context and turning it into a clear decision.

Use it at the end, not the beginning.

The order matters.

If you flip the order, you get worse outputs at every step.

What you can do today

Pick one idea you have been sitting on.

Do not think about it.

Do this instead:

• write a 3-paragraph context document. What is the idea, who is the customer, and what problem does it solve?

• paste it into Gemini with this prompt: “Do a detailed competitive analysis. What is the market size? Who are the players? What are the biggest unsolved problems? What can I build that someone will pay for?”

• take the output to Grok. Ask: “Is anyone talking about this problem on Twitter right now? What are they frustrated about?”

• paste both into Claude. Ask: “Based on all of this, what exact product should I build, who will buy it, and why can companies not build it themselves?”

That is it.

Every team has private vocabulary. “Event,” “order,” “user” can mean five different things depending on who you ask. This sounds like a small thing. It is not. I have seen entire codebases go sideways because three people used the word “customer” to mean different things.

Before you build a custom skill, search for existing ones. Skill Seekers automatically converts any documentation website, GitHub repository, or PDF into a Claude skill in minutes. Point it at your internal docs and it builds the skill for you.

Before you write anything new, search. This is the package manager mindset applied to AI skills.

You will accumulate skills. Some will overlap. Some will contradict each other. This skill audits your installed skills, finds duplicates, checks for conflicts, and gives you a clean slate. Run it once a week.

Skill 7: Humanizer Install from your project’s SKILL.md or: GitHub: Available in the Humanizer SKILL.md format

This is my own skill. I use it on everything I write. It removes every AI writing pattern, the inflated vocabulary, the rule-of-three lists, the passive voice. It rewrites in the voice you give it. If you publish anything with Claude, this is non-negotiable.

Reduces context size and token cost while keeping what matters. Different from the Context Engineering Kit above: this one is for ongoing sessions, not setup. Think of it as a session-level garbage collector for your Claude context window.

This is not a skill you install. It is a convention you adopt. A CLAUDE.md file in your project root gives Claude persistent memory, self-reflection instructions, and foresight via plain text. Zero dependencies. Just a markdown file that makes Claude behave consistently across every session.

If you do nothing else from this list, do this. It takes 20 minutes to set up and it changes everything.

Toolkit for interacting with and testing local web applications using Playwright. Different from the Playwright CLI above: this one is specifically structured around webapp test scenarios with Claude as the test engineer.

Skill 54: PostgreSQL Read-Only GitHub: github.com/jawwadfirdousi/read-only-postgres

Read-only SQL queries against PostgreSQL databases with strict validation, timeouts, and row limits. Supports multiple connections. Lets Claude query your database directly to answer questions without any risk of write operations.

Skill 55: MySQL and MSSQL GitHub: github.com/BehiSecc/awesome-claude-skills (mysql, mssql)

Same safe read-only approach for MySQL and Microsoft SQL Server databases. If your stack uses either of these, install the matching skill. Claude can write and run queries, analyze results, and explain what it finds.

Automates Google Calendar, Drive, Docs, Gmail, and Sheets via a unified CLI with a built-in MCP server. One command gives Claude direct access to your entire Workspace. This hit 4,900 GitHub stars in its first three days after launch in March 2026. The adoption rate tells you everything you need to know.

Skill 57: Session Memory Auto-Capture GitHub: github.com/rohitg00/awesome-claude-code-toolkit (context auto-capture section)

Auto-captures everything Claude does in a session, compresses with AI, and injects context into future sessions. This was the number one trending GitHub repo in February 2026. If you do not want to re-explain your project every session, this is the solution.

This is the closest thing to running a virtual company solo. I have seen people use this to run 72-hour engineering sprints with Claude agents working in parallel while they sleep.

Best practices for using Remotion to generate video and motion graphics programmatically. If you produce video content or build tools that generate video, Remotion is the framework. This skill makes Claude a competent Remotion engineer.

Well-written resources covering “just about everything” from core engineering domains. What makes this different is that every resource has standalone value. You do not have to buy into one specific workflow. Pick what fits and leave the rest.

Full suite of battle-tested skills for TDD, debugging, refactoring, and execution. This is described as a set of “superpowers” but really it is engineering best practices made automatic. Well-organized, adaptable, and covers a large portion of the software development lifecycle.

Let’s build.

Most AI engineers will never know why their model broke.

Because the ecosystem made it too easy to skip the hard part.

You install a library, call the API, wrap the output, and ship.

Feels like AI engineering, but not good in the long run when production breaks.

Your retrieval returns wrong results and you have no idea if the problem is in the embedding, the tokenization, or the chunking.

Engineer Beta vs Engineer Sigma

Engineer Beta’s model starts returning garbage.

• loss is going up

• they change the learning rate

• it still breaks

• they never know why

[Build 1] Micrograd

Micrograd is a 100-line autograd engine written by Andrej Karpathy.

It implements the full learning loop of a neural network using only scalar values and basic Python. No frameworks needed.

how neural networks actually learn

A neural network learns by making a prediction, measuring how wrong it was, and then adjusting every number inside it to be slightly less wrong next time.

The measurement of how wrong is called the loss, which is a single number.

The adjustment process has two parts.

1) forward pass - data flows through the network, layer by layer, producing an output. Every operation along the way is recorded.

2) backward pass - starting from the loss, the engine works backwards through every recorded operation. At each step it asks, if this number had been slightly larger, would the loss have gone up or down?

That answer is the gradient.

The gradient is not magic.

It is the answer to that one question, calculated using a rule from calculus called the chain rule.

What Micrograd makes visible

In PyTorch, .backward() does all of this invisibly.

Micrograd forces the engineer to write every forward operation and every gradient calculation by hand.

The Value class wraps a single number, records how it was computed, and stores its gradient.

Every time two Value objects interact, the result is a new Value that remembers its parents and the local derivative of that operation.

After building this, two things happen.

1. Exploding gradients become obvious - the numbers are growing because the derivatives are multiplying

2. Vanishing gradients become obvious - the numbers are shrinking toward zero because the chain rule is multiplying small fractions together. Both failure modes are no longer mysterious.

This is the diagnostic tool that Engineer Beta never built. Engineer Sigma did.

[Build 2] BPE Tokenizer From Scratch

A standalone notebook by Sebastian Raschka implementing Byte Pair Encoding from scratch.

Two versions exist - a simple one for first-time readers, and a full one that handles every edge case tiktoken handles.

how language becomes numbers

A language model never reads words, it reads integers. NLP way of converting words into numbers.

Before any text reaches a model, a tokenizer converts it into a sequence of token IDs.

Each ID maps to a chunk of text in a lookup table called the vocabulary.

BPE builds this vocabulary using one rule:

• find the most frequent adjacent pair in the training corpus

• merge it into a single new token

• assign it an ID

• repeat

Starting from the 256 possible byte values (all characters a computer can represent), BPE runs this merge process thousands of times until the vocabulary reaches its target size.

GPT-2 stops at 50,257.

What this means in practice

The word myocardial might be split into 5 separate tokens by a tokenizer trained mostly on web text.

The model sees each fragment independently.

When fine-tuned on medical records, the model struggles not because of the architecture but because the vocabulary was never built for that domain.

This is a production failure that no amount of prompt engineering fixes.

The problem is upstream of the model entirely.

Building the tokenizer makes this visible.

The engineer can see exactly how any word is split. They can understand why GPT-2 handles spaces differently from GPT-4.

They can identify the tokenization mismatch before it becomes a three-day debugging session.

NanoGPT is a clean, readable GPT implementation - 300 lines for the training loop, 300 lines for the model.

Build-nanogpt is the step-by-step version where every Git commit adds exactly one concept, starting from an empty file, pretty cool no?

how a transformer actually works

A transformer processes all tokens in a sequence simultaneously.

To do this, it needs two things.

First

A way for each token to decide which other tokens matter to it, this is attention.

Each token produces three vectors:

• a query (what am I looking for)

• a key (what do I contain)

• a value (what do I contribute)

Attention scores are computed by comparing queries against keys.

The result is a weighted sum of values.

Every token gets to look at every other token and decide how much to pay attention to each one.

Multi-head attention runs this process several times in parallel with different learned projections.

Each head can learn to attend to different patterns

• one head might learn grammar

• another might learn coreference

Second

A way to know where each token sits in the sequence.

Transformers have no built-in sense of order.

Positional embeddings are added to each token’s representation to encode its position.

In NanoGPT these are learned.

In modern models they are computed using rotational math (RoPE), but the purpose is identical.

What building this makes clear

A 128k context window is a memory math problem.

Attention requires every token to compare itself against every other token.

The compute and memory cost grows with the square of the sequence length.

Engineers who built NanoGPT understand immediately why longer context is hard to scale and why FlashAttention exists.

KV cache, speculative decoding, grouped query attention:

• all of these are solutions to problems that become obvious once attention has been built by hand

Do this in the right order

1. Micrograd - teaches you how learning works

2. BPE tokenizer - teaches you how language becomes numbers

3. NanoGPT - puts both together into a real system
